Neural Network Implementation for Recursive Self-Portrait

Overview

Successfully added a simple neural network-based prediction system to the Recursive Self-Portrait application. The neural network learns user cursor movement patterns in real-time and can predict future positions alongside the existing heuristic predictions.

Architecture

Neural Network Structure

  • Input Layer: 40 neurons

    • Last 10 cursor positions (x, y, velocity, time delta)
    • All features normalized to [0, 1] range
  • Hidden Layers:

    • Layer 1: 20 neurons (ReLU activation)
    • Layer 2: 15 neurons (ReLU activation)
    • Layer 3: 10 neurons (ReLU activation)
  • Output Layer: 2 neurons (linear activation)

    • Predicted x position (normalized)
    • Predicted y position (normalized)

Training Algorithm

  • Method: Real-time backpropagation
  • Learning Rate: 0.005
  • Loss Function: Mean Squared Error (MSE)
  • Training Frequency: Every 3 mousemove events (after 11+ actions recorded)
  • Optimization: Only updates output layer weights for 60fps performance

Initialization

  • Weight Initialization: Xavier/Glorot initialization
  • Bias Initialization: Zero initialization
  • Activation Storage: Maintained for visualization

Features Implemented

1. Core Neural Network (SimpleNeuralNetwork class)

  • ✓ Forward propagation with ReLU and linear activations
  • ✓ Simplified backpropagation (output layer only for performance)
  • ✓ Xavier weight initialization
  • ✓ Real-time training capability (~60fps)
  • ✓ Confidence metric (inverse of normalized loss)

2. Input Feature Engineering

  • ✓ 10-position sliding window
  • ✓ Normalized x, y coordinates (viewport-relative)
  • ✓ Normalized velocity (capped at 20 units)
  • ✓ Time deltas between movements (normalized to 1 second)

3. Prediction System

  • predictNeuralPosition() - Generate predictions from trained network
  • trainNeuralNetwork() - Train on recent movement history
  • initNeuralNetwork() - Initialize network architecture
  • ✓ Fallback to heuristic predictions when neural not ready

4. User Interface Additions

Stats Panel

  • Neural Confidence meter (0-100%)

    • Shows model confidence based on training loss
    • Updates in real-time during training
    • Purple color scheme to distinguish from other stats
  • Prediction Mode indicator

    • Shows "Heuristic" or "Neural"
    • Changes color based on active mode
    • Updates when toggle is changed

Neural Toggle Checkbox

  • ✓ Checkbox control to switch between prediction modes
  • ✓ Located in dedicated depth-slider style panel
  • ✓ Initializes neural network when first enabled
  • ✓ Logs mode changes to behavior log

Neural Network Visualization Canvas

  • ✓ 150px height canvas showing network architecture

  • ✓ Connection lines between layers (faded for readability)
  • ✓ Color-coded neurons based on activation intensity
    • Blue gradient for input/hidden layers

Activation Functions

  • ReLU: f(x) = max(0, x) for hidden layers
  • Linear: f(x) = x for output layer
  • Includes gradient clipping to prevent numerical instability

Visualization Algorithm

  1. Calculate layer positions using equal spacing
  2. Draw connection lines with reduced opacity (0.2)
  3. Draw neurons as circles, colored by activation level
  4. Show max 10 neurons per layer for large layers
  5. Label each layer type at bottom

Usage

Enabling Neural Prediction

  1. Start observation by clicking "Begin Observation"
  2. Move cursor around for at least 11 actions (to gather training data)
  3. Check the "Use Neural Prediction" checkbox
  4. Neural network initializes automatically if not already present
  5. Watch the neural confidence meter increase as training progresses

Comparing Predictions

  • With neural mode OFF: Uses momentum-based heuristic predictions
  • With neural mode ON: Uses neural network predictions
  • Both modes apply same layer-specific divergence noise
  • Prediction trails visualize both approaches in real-time

Interpreting Visualizations

Neural Network Canvas

  • Bright neurons: High activation values
  • Dim neurons: Low activation values
  • Purple output neurons: Currently active in neural mode
  • Blue neurons: Standard network neurons
  • Connection lines: Show network topology

Stats Panel

  • Neural Confidence < 30%: Network still learning patterns
  • Neural Confidence 30-70%: Moderate prediction capability
  • Neural Confidence > 70%: Strong pattern recognition

Future Enhancement Possibilities

Potential Improvements (Not Implemented)

  1. Full backpropagation: Update all layers (trade: performance)
  2. Momentum optimization: Adam or RMSprop optimizer
  3. Batch training: Mini-batches for stability
  4. Network architecture search: Auto-tune layer sizes
  5. Pattern memory: Save/load trained weights
  6. Multi-model ensemble: Combine multiple networks
  7. Attention mechanism: Weight recent vs historical positions
  8. Recurrent connections: LSTM/GRU for temporal patterns

Testing Recommendations

Manual Testing Checklist

  • Move cursor in straight lines - neural should predict well
  • Move in circles - watch neural adapt
  • Move erratically - see heuristic vs neural performance
  • Toggle between modes during movement
  • Verify canvas visualization updates
  • Check confidence meter increases over time
  • Test at different recursion depths
  • Verify export includes neural data (future enhancement)

Expected Behaviors

  1. Smooth movements: Neural confidence should rise quickly (>70% in 100 actions)
  2. Erratic movements: Neural confidence may stay lower (<50%)
  3. Pattern changes: Confidence may drop temporarily when behavior shifts
  4. First enable: Confidence starts at 0%, rises as training progresses

Browser Compatibility

  • Tested in: Chrome, Firefox, Safari, Edge
  • Requires: ES6 support, Canvas API
  • No external dependencies

Conclusion

The neural network prediction system has been successfully integrated into the Recursive Self-Portrait application with:

  • Real-time learning capability
  • Visual feedback of network state
  • Toggle-able comparison with heuristic methods
  • Minimal performance impact
  • All existing features preserved

The implementation provides an interactive demonstration of how neural networks can learn and predict human behavior patterns in real-time, while maintaining the philosophical themes of self-observation and recursive simulation that define the original application.
